RAG works by combining a retrieval step (finding the relevant documents or passages from your enterprise knowledge base that are relevant to the user's question) with a generation step (providing those retrieved passages as context to the language model, along with the question, so the model generates an answer grounded in the retrieved information rather than its general training knowledge). The retrieval component uses vector databases — databases that store document embeddings (mathematical representations of text meaning) and can find documents that are semantically similar to a query even when they do not share exact words. IBM watsonX.ai provides tools for building the full RAG pipeline: the IBM Watson Discovery or watsonX.data connection for document ingestion, the embedding model for creating vector representations, the vector index for similarity search, and the Prompt Lab plus watsonX.ai APIs for the generation step. AutoAI is Watson Studio's automated machine learning feature — and it is genuinely impressive at what it does for structured data ML problems. Given a dataset and a target column, AutoAI automatically runs a pipeline optimisation process: testing multiple algorithms (XGBoost, Random Forest, Gradient Boosting, Logistic Regression, and more), testing multiple feature engineering transformations (handling missing values, encoding categorical variables, scaling numerical features), and generating a ranked leaderboard of the best-performing pipelines with their cross-validation scores. Students use AutoAI on a banking credit risk dataset — watching it automatically build and evaluate 16 different model pipelines, select the best one, and generate a deployable model — and then use the generated Jupyter notebook to understand exactly what AutoAI decided and why, so they can refine or extend it manually. Manual model development in Jupyter notebooks using scikit-learn and pandas is covered for problems where AutoAI's automated approach is insufficient — custom feature engineering, time-series prediction, and models that need to incorporate business rules that cannot be expressed as features. Watson Machine Learning deployment — exposing a trained model as a REST API endpoint that other applications can call for real-time predictions — is covered with Python code that calls the deployed endpoint and integrates it into a simple web application.
watsonX Assistant's core model is intent-based: the NLP model is trained to recognise the user's intent (what they are trying to accomplish) from their message, regardless of exactly how they phrase it. Watson Discovery ingestion covers the process of loading documents (PDFs, Word documents, HTML pages, JSON) into a Watson Discovery collection, with the built-in enrichment pipeline that automatically applies NLP analysis to each document as it is ingested: extracting entities (company names, person names, locations, dates, monetary amounts), identifying key concepts, determining sentiment, extracting key phrases, and identifying document categories. Drift monitoring detects changes in the statistical distribution of the input features (data drift) or the model's output distribution (prediction drift) that signal the model needs retraining. Fairness monitoring — the capability most specific to regulated industry AI — tests whether the model produces systematically different outcomes for different demographic groups (defined by attributes like age, gender, or ethnicity) at a rate that exceeds acceptable thresholds.
